AI: The Double-Edged Sword

For data governance, AI can be a double-edged sword. On the one hand, it’s revolutionary technology that automates data processes, helps detect anomalies, and improves compliance. On the other hand, it can introduce new risks, biases, and ethical dilemmas into a company’s software systems. The question executives looking to add AI to their networking systems need to ask is, “Do the advantages outweigh the disadvantages?” Unfortunately, like most things with software technology, that’s not an easy question to answer. When it comes to IT networking, this is an important question to ask because this department is, literally, the digital life blood of a company. Network goes down; company goes under.

In her paper, Artificial Intelligence in Network Engineering and Consulting: Enhancing Efficiency and Custom Solutions,
Catherina Chen Lin Hu asks the question, “To what extent does AI assist network consultants and engineers in enhancing the efficiency and accuracy of engineering processes?” She breaks the question down into the following four sub-categories:

  1. What is the impact of AI on standard engineering tasks?
  2. What is AI’s role in addressing customized requirements?
  3. What is the potential for time and cost savings?
  4. What are the challenges associated with an AI integration?

Hu’s research highlights the technical challenges facing AI implementations. These include disconnected data systems, data integration difficulties, ethical concerns about job displacements, the issue of trust in an AI system, and regulatory compliance concerns. “Despite these challenges, the revolutionary potential of AI is clear, offering significant time and cost savings in standardized tasks and providing a supportive role in customization,” argues Hu.

What is Data Governance?

Data governance is a structured approach to managing and supervising data within an organization. It defines policies, procedures, roles, and responsibilities to ensure data is always accurate, accessible, used responsibly, and secure across its lifecycle. In my article, Foundations of Enterprise Data Governance, I write:

“Data governance is the system of decision rights and accountabilities for information-related processes, executed according to agreed-upon models that describe who can take what actions with what information, and when, under what circumstances, and using what methods. In essence, data governance is crucial for enterprise organizations due to the complexity and distribution of data assets. It ensures the quality, security, and accessibility of data, enabling organizations to make informed decisions and maintain a competitive business edge.”

Key components of data governance include:

  • Data Quality – Ensures data is accurate, consistent, and reliable.
  • Data Security & Privacy – Protects sensitive data from breaches (e.g., GDPR, HIPAA compliance).
  • Data Stewardship – Assigns responsibility for data management (e.g., Data Owners, Stewards).
  • Metadata Management – Documents data definitions, sources, and usage.
  • Compliance & Regulations – Ensures adherence to laws (e.g., GDPR, CCPA).
  • Data Access & Usage – Controls who can access and modify data.
  • Master Data Management (MDM) – Maintains a single, trusted version of key data (e.g., customer, product info).

Data governance ensures a company’s data is trustworthy, which exponentially increases its usefulness.

Data Quality

In its Definitive Guide to Data Governance, Talend states, “We’ve entered the era of the information economy, where data has become the most critical asset of every organization. Data-driven strategies are now a competitive imperative to succeed in every industry. To support business objectives such as revenue growth, profitability, and customer satisfaction, organizations are increasingly relying on data to make decisions.” For Talend, data-driven decision-making lies at the heart of every company’s digital transformation initiative.

To fuel their digital transformations, Talend believes, organizations must solve two data problems at once; make their data timely and trustworthy. Although digital transformations overly rely on speed, speed is not enough. For data to enable effective decision-making and deliver outstanding customer experiences, organizations need trustable data, says Talend. “Being able to trust your data is about remaining on the right side of regulation and customer confidence, and it’s about having the right people using the right data to make the right decisions. And this too is a major challenge for organizations,” contends Talend.

AI models will fail if they utilize poor, biased, or incomplete data. The overused cliché “Garbage In, Garbage Out” is just that — an overused cliché — because it is a truism that only grows truer over time. “One man’s garbage might be another man’s treasure”, but not when it comes to data. One man’s garbage data will always be another man’s garbage data, that’s just how data works. One way to ensure a company’s data is accurate is to be certain every corporate department is working with the same data set.

A Single Source of the Truth

Multiple versions of a dataset, whether they are sales figures on a spreadsheet, customer or employee records in a CRM, ERP, or POS system, can lead to conflicts among departments. AI technology, like natural language processing (NLP), can extract, validate, and standardize information from text to ensure both data accuracy and consistency. Decisions based on outdated or conflicting data can result in costly errors that reverberate through an entire organization, causing problems that compound and compound upon each other.

Employees can waste time reconciling data across data integration, business intelligence, analytics, and digital marketing tools. Dirty, fragmented data can cripple analytical models built with AI. The “1-10-100 rule” might be conceptual to some, but it accurately illustrates how the cost of addressing a data quality issue increases significantly as it moves through different stages of a data’s lifecycle. Essentially, it costs $1 to verify data when it is entred, $10 to correct it later, and $100 if the issue is not addressed before it is heavily utilized, which can lead to significant downstream problems.

With a single source of the truth solution, automated data pipelines feed data into one system (Snowflake, Databricks, Hadoop, etc.), reducing manual work. Leaders trust they’re acting on real-time, accurate data. Audit trails and permissions are centralized. Modular data architectures, like data lakehouses, can scale without fragmentation and clean, unified data can be used to train accurate AI models.

Ensuring Data’s Veracity

AI can play a significant role in maintaining and improving data integrity. It ensures all data is accurate, consistent, and reliable throughout its lifecycle. ML models can detect deviations from expected data patterns, like fraudulent transactions, incorrect entries, and then suggest or apply fixes for missing, malformed, or inconsistent data. AI can continuously monitor data streams and proactively flag integrity issues. Deep learning anomaly detection algorithms can uncover manipulated or falsified data and cleanse it as needed.

AI can predict where data integrity risks might arise based on past failures. It can then recommend preventive measures. AI-powered master data management (MDM) tools can help corporations maintain the all-important “single source of truth” by resolving conflicts in the company’s master data. Drawing upon a single source of truth is important because having a centralized, authoritative data repository ensures a company’s data is consistent, accurate, and reliable across an entire organization. It eliminates data silos and data inconsistencies to ensure the data’s veracity throughout the company.

Network Security

In their paper AI-Powered Networking: Unlocking Efficiency and Performance, Yadav et al. claim, “The complexity of modern networks necessitates intelligent management solutions.” Few would argue with this statement. The integration of AI “into networking marks a paradigm shift that holds immense potential to revolutionize the way we design, operate, and secure networks,” say Yadav et al.

AI enhances network security by detecting and mitigating cyber threats in real-time. ML models can identify unusual patterns suggestive of security breaches and respond proactively to protect a network. “With the ability to analyse vast volumes of data in real-time, AI-powered analytics offer insights that have the potential to reshape network operations,” says Yadav et al. Network security has been raised by the infusion of AI, contend Yadav et al. “Advanced algorithms capable of identifying and responding to emerging threats in real-time bolster network defences, ensuring a robust cybersecurity posture,” say Yadav et al.

AI trained on historical network data can identify irregular patterns indicating potential cyber threats, facilitating early recognition of emerging threats like Distributed Denial of Service (DDoS) attacks and previously unknown vulnerabilities, say Yadav et al. Intrusion Detection Systems (IDS) analyze network traffic, system logs, and user behaviors with AI to spot known — and even previously unknown — attack patterns and then dynamically adapt to ever-evolving attack vectors, contend Yadav et al. This ensures a more agile defense against constantly adapting and improving cyber threats.

Intelligent Traffic Management

AI is transforming network traffic management by optimizing data flows, preventing congestion, and ensuring Quality of Service (QoS) across telecom, cloud, and enterprise networks. Products like Cisco’s ThousandEyes use AI to provide visibility into the performance of networks as well as predict network outages before they occur. ML algorithms can analyze traffic patterns from routers, switches, and endpoints and “analyze factors like traffic load, latency, and link quality to pick the most efficient paths for data transmission,” say Yadav et al. AI algorithms can identify inefficiencies and bottlenecks in existing protocols. These insights enable “the development of new protocols that address specific network challenges, such as minimizing overhead, improving reliability, or accommodating diverse traffic patterns,” say Yadav et al.

AI-driven routing and protocol design contribute to improved QoS provisioning by ensuring optimal resource allocation and traffic prioritization. ML models predict network congestion and dynamically adjust routing paths to maintain desired QoS levels for critical applications. “This approach enhances user experiences by minimizing delays and packet loss,” says Yadav et al.

AI algorithms can learn data traffic patterns, redirect traffic to less congested paths as necessary, redistributing loads evenly, which will reduce latency, claim Yadav et al. AI processes extensive amounts of network data to provide insights on performance, user behavior, and potential improvements, facilitating strategic planning and network development.

Network Slicing

Network slicing divides a single physical network into multiple virtual, independent networks, each optimized for specific use cases, such as IoT or mobile broadband. It allows network providers to offer differentiated services. “Network slicing, enabled by AI, allows the creation of virtualized network segments tailored to specific QoS requirements. AI algorithms optimize the allocation of resources to each slice based on individual QoS demands, ensuring isolation and optimal performance for diverse applications,” say Yadav et al.

Resource allocation ensures each slice gets the necessary bandwidth, latency, and reliability without interference. ML models “trained on historical network data pinpoint patterns of network congestion and dynamically allocate resources to critical applications,” claim Yadav et al. “This approach minimizes latency, packet loss, and ensures a consistent and reliable user experience,” contend Yadav et al.

AI Predictive Maintenance

Machines of all kinds fail and often in highly predictable ways. This is where AI’s predictive maintenance capabilities come in. AI can anticipate equipment failure based on historical data and performance parameters, allowing network engineers to address potential problems before they lead to downtime, say Yadav et al. This improves network reliability, optimizes resource allocation as well as improves decision-making, the writers add.

AI-driven network management proactively identifies potential network failures before they occur. “By analysing historical data and real-time telemetry, AI algorithms can detect anomalies or degradation in network performance, allowing for timely intervention. This approach reduces downtime, improves service availability, and minimizes operational costs. For instance, ML models can predict hardware failures or identify deteriorating link quality, enabling network administrators to take preventive actions before true problems arise, say Yadav et al.

Assessing data traffic patterns, ML algorithms can predict and prevent problems, optimize resource allocation, and ensure seamless operations, contends Hu. “AI empowers network automation by enabling the creation of self-configuring, self-healing, and self-optimizing networks. Automated network orchestration uses AI algorithms to dynamically allocate resources, configure devices, and optimize network topology” say Yadav et al.

In her paper, Artificial Intelligence in Network Engineering and Consulting: Enhancing Efficiency and Custom Solutions, Hu states, “The results indicate that AI significantly enhances efficiency and accuracy in engineering tasks by automating processes such as network configuration and performance monitoring, thus minimizing errors and optimizing workflows.” Predictive maintenance enables proactive issue resolution and minimizes operational downtime, but AI can be limited by its dependence on resource-intensive processes and the need for domain-specific data, meaning human expertise is still needed to address client-specific requirements,” Hu concludes.

A Perpetual Arms RAIce

AI-driven threat intelligence platforms leverage ML to analyze vast quantities of security data, generating data-driven actionable insights. By correlating diverse threat indicators and contextual information, these platforms predict potential security breaches and recommend appropriate mitigation strategies. Predictive analysis helps organizations in proactively countering evolving cyber threats. ML’s adaptive learning capabilities are particularly suited to thwart cyber criminals. “AI-driven firewalls and intrusion prevention systems can dynamically adjust rule sets based on emerging threat patterns. Additionally, AI-powered deception technologies divert attackers from valuable assets, granting security teams additional response time,” claim Yadav et al.

As I mentioned previously, AI is a double-edged sword, as malicious actors have learned how to utilize AI to create unique cybersecurity threats. This has kicked off a new, perpetual arms race that pushes innovation on both sides of the cybersecurity spectrum, contend Yadav et al.

Challenges & Considerations

As with all powerful, cutting-edge technology, like AI, integrating it into a networking system will create plenty of challenges. These include ethical concerns, data privacy, and regulatory compliance, to name a few. While integration of AI into networking introduces transformative capabilities, it also brings forth considerable challenges. “The collection, processing, and utilization of vast amounts of data in AI-driven networks raise ethical questions related to user privacy and data protection. Balancing the benefits of AI-enabled insights with the need to safeguard sensitive information requires robust privacy-preserving mechanisms, transparent data usage policies, and compliance with data protection regulations,” say Yadav et al.

Biases in an AI model’s training dataset can infect the model, leading to biased outcomes that disproportionately affect certain user groups. These problematic models can contain hidden prejudices, amplifying biases in hiring, lending, or policing. If AI learns from historical data (e.g., biased hiring practices), it perpetuates discrimination. Amazon had to scrap an AI recruiting tool because it downgraded female candidates. Its training dataset consisted of mostly male developer resumes because, in the past, coding has predominantly been a male profession.

Organizations need to constantly ensure fairness and equity in their AI-enabled networking. They should develop methods to audit, interpret, and rectify biased AI decisions by uncovering and mitigating algorithmic biases, recommend Yadav et al.

AI’s Blackbox Quality

Sometimes it can be difficult to understand what an AI algorithm is doing under the hood. This is a particular problem with ML models, especially unsupervised ones. These models can have a blackbox quality to them because they are given a goal but no methodology to attain that goal. These model’s inherent complexity can make them hard to interpret and understand as well. “Lack of explainability raises concerns, particularly in critical applications such as healthcare and autonomous systems. Efforts to develop interpretable AI models and techniques to explain decision-making processes are essential for building trust and accountability,” contend Yadav et al. Companies should prioritize interpretable models. For example, decision trees over neural nets when and if possible.

AI can itself play a significant role in addressing ethics and bias, but its effectiveness depends on how the AI is designed, deployed, and administered. Techniques like reweighting training data, adversarial debiasing, and fairness constraints can reduce bias in AI decision-making. Tools like IBM’s Fairness 360 or Google’s What-If Tool can help audit AI models for discriminatory patterns. Diverse data teams should review training datasets to ensure they are not inherently biased. Methods like Local Interpretable Model-agnostic Explanations (LIME) or SHapley Additive exPlanations (SHAP) help make AI decisions interpretable, so users can understand why a model makes a particular choice. AI audit trails mean systems can log decisions made before, during, and after modeling, making it easier to trace and correct unethical outcomes.

Future Directions for AI Data Governance

The next phase of AI data governance will focus on AI explainability, ethics, and accountability. As AI system automation grows, organizations will demand their data stewardship and compliance tasks make decisions that are both transparent and explainable to regulators, employees, and stakeholders alike. This means investments in AI models and tools have to deliver accurate results as well as provide clear explanations for their outputs. These outputs will have to be fully supported for any ethical scrutiny or regulatory demands. Regulatory frameworks, such as the General Data Protection Regulation (GDPR), the EU AI Act, and the California Consumer Privacy Act (CCPA) are expected to drive stricter requirements for transparency and fairness in AI governance. The following technology will help businesses remain compliant with those — and a lot of future — governance laws:

Automation

Powered by AI and machine learning, automation will continue to transform data governance. Manual processes for data classification, quality checks, and policy enforcement are becoming unsustainable as data volumes and data complexity grow. AI-driven tools will automate the detection of sensitive data, suggest tags, enforce retention policies, and flag anomalies in real time. These automation tools are increasingly embedded directly into data pipelines and applications, enabling adaptive, continuous governance that can keep pace with the business’s changing regulatory environment.

Privacy-first Governance

This framework prioritizes user privacy, security, and compliance rather than treating these as secondary afterthoughts. It ensures personal data is collected, stored, and processed in a way that limits risks while complying with regulations like GDPR, CCPA, and Singapore’s PDPA. Privacy-first governance is becoming standard. Today’s data governance systems, implemented with the support of experienced data governance consultants, must now track data lineage, manage user consent, and implement features like the right to be forgotten. Techniques such as federated learning allow AI models train across distributed data sources without centralizing sensitive information, preserving privacy while enabling corporate collaboration.

Blockchain

Although blockchain does have a negative connotation for many people because of its association with cryptocurrency scams and cyber fraud, the technology has emerged as a powerful tool for data governance. It offers secure, transparent, and decentralized frameworks for managing data. Smart contracts can automate compliance verifications and AI agents can trigger workflow actions when non-compliance is detected. It provides tamper-proof records of data access and changes. This is particularly valuable in multi-organization environments, such as supply chains or global financial networks, where trust and traceability are the most important thing. Decentralized ownership models and blockchain integration are also gaining momentum, providing immutable audit trails and automating compliance through smart contracts.

Tailored Governance

As organizations scale, one-size-fits-all governance models are giving way to personalized, context-aware policies. AI will increasingly tailor governance logic to the needs of specific business units, user segments, or operational contexts. For example, data scientists may require broader access to raw data, while finance teams need stricter controls. AI-driven governance will learn and adapt to these operational nuances, balancing agility and control for productivity and compliance.

A Unified Governance Framework

Dovetailing with tailored governance is a unified governance framework that combines AI-driven policy enforcement, real-time risk management, and automated data classification across all data assets. Governance is shifting from a compliance obligation to a competitive advantage, enabling organizations to build trust, accelerate AI adoption, and confidently expand into new markets.

Tools & Technology

AI governance tools serve as central repositories for AI metadata, often including AI registries that provide a unified view of all AI applications within an organization. Although an entire article could be written on AI data governance tools, there are a few that stand out. Microsoft Purview offers integrated data governance solutions that help organizations manage their data wherever it resides. AWS Glue is a managed data integration service that can automatically catalog data from on-premises databases, data lakes, and SaaS applications. AWS Lake Formation has robust access control and auditing capabilities that help organization centrally define and enforce permissions while monitoring the company’s data access. Other strong tools include Collibra, Alation, Informatica Axon, and IBM Watson Knowledge Catalog.

The future of AI and data governance is defined by explainable, automated, privacy-first, and decentralized frameworks. The integration of blockchain, hyper-personalized policies, and continuous stakeholder engagement will be essential. Organizations that lead with intelligent, adaptive governance will unlock the full value of AI while maintaining trust, security, and regulatory compliance. AI might not be a panacea for every corporate data ill, but it will be a helpful provider.

High-quality data minimizes errors in AI algorithms. Effective data governance frameworks provide a solid foundation for experimenting with new AI technologies. Automated data quality checks and monitoring ensure data accuracy and reliability in AI applications. Routine audits of data quality are crucial for showing compliance with regulatory standards. Transparency and accountability in data processes build trust among stakeholders in AI decision-making.

From Chaos to Control

AI’s role in data governance embodies a paradox: it is both a powerful enabler as well as a potential disruptor. On the one hand, it can revolutionize data management by automating compliance, enhancing security, and optimizing network performance. On the other hand, it introduces unnecessary risks into the data process. Biased algorithms, ethical dilemmas, and opaque decision-making are not problems to be taken lightly as each one of these issues demands rigorous oversight.

Today, AI is transforming data governance from a nice-to-have into a business imperative. Trust, compliance, and context are now central to the success of AI initiatives. Organizations need to ensure their data is governed well enough, often with the support of expert data governance consulting, to support advanced analytics, generative AI, and data-driven decision-making. This requires moving beyond checklists and static rules to intelligent, embedded, and real-time governance that accelerates innovation while safeguarding quality and compliance.

While a digital AI transformation waits for no man — or company — it’s never too late to start. The effort is worth it, claims McKinsey. “Rewiring a business with key digital and AI capabilities constitutes a true competitive advantage,” argues McKinsey, who found companies committing to the process made “meaningful improvements (approximately 15 to 20 percent improvement, on average) in digital maturity and increase EBIT by 10 to 20 percent within their targeted domains in two to three years.” The benefits are concrete, but so are the drawbacks. McKinsey warns laggards will find it difficult to remain competitive. “The sooner companies commit to building the right digital and AI capabilities, the sooner they can start generating compounding growth,” they say.
